Beyond Citation Popularity: A Multi-Objective Evaluation of Citation-Informed Representations for Scientific Paper Recommendation
This repository contains the official implementation, data streaming engine, multi-objective Pareto optimization framework, statistical validation suite, and 28 publication figure generators for the paper: "Beyond Citation Popularity: A Multi-Objective Evaluation of Citation-Informed Representations for Scientific Paper Recommendation".
Existing scientific paper recommenders present a fundamental dilemma:
-
The Language Model Glass Ceiling: Dense Transformer Language Models (SciBERT, SPECTER2, LinkBERT, BGE-Large) evaluate abstracts in pure semantic space. While maintaining high novelty, they suffer a strict empirical ceiling:
$\text{NDCG}@5 \le 0.0979$ . Swapping one checkpoint for another yields no statistically significant improvement ($p > 0.05$ ). -
The Citation Graph Trap: Structural co-citation graph recommenders capture direct scientific relationships, but suffer a catastrophic Novelty Collapse (
$\text{Novelty}@5 = 0.0333$ ) and extreme popularity bias ($\text{Gini} = 0.0376$ ). They repeatedly surface the top 1% hyper-cited "landmark" papers while burying long-tail innovations.
Our research breaks this zero-sum trade-off by establishing a Popularity-Calibrated Multi-Objective Re-Ranking Architecture. By decoupling candidate retrieval from multi-signal re-ranking, we jointly model:
-
Semantic Alignment (
$\mathbf{e}_X \cdot \mathbf{e}_Y$ ) -
2-Hop Bibliometric Coupling & Co-Citation Overlap (
$S_{link_2hop}$ ) - Recency Decay ($\exp(-\lambda \Delta t)$)
- Popularity Penalty ($\log(1 + C_Y)$)
- Seed-Adaptive Dynamic Weighting & Pairwise LambdaMART Ranking
-
$\mathbf{+305.3%}$ NDCG Accuracy Boost ($\text{NDCG}@5 = 0.3814 \pm 0.0742^{}$):* Ablation configurationsA2(Semantic + Link) andA3(Sem + Link + Recency) smashed the baseline glass ceiling, achieving an unprecedented$\text{NDCG}@5 = 0.3814$ and$\text{MRR} = 0.7708$ ($p = 0.0000^{***}$ vs LinkBERT$0.0941$ ). -
$24.0\times$ Discovery Novelty Expansion ($\text{Novelty}@5 = 0.8000 \pm 0.0951^{}$):* The Proposed Multi-Objective System (M9/A4) achieved a massive$\text{Novelty}@5 = 0.8000$ βa$24.0\times$ increase over Citation-Only systems ($0.0333$ ) and$+93.9%$ over LinkBERT ($0.4125$ ). -
High Intra-List Diversity (
$\text{ILD} = 0.7564$ ): Integration of Maximal Marginal Relevance (MMR) diversification prevents topic repetition and expands sub-field coverage. -
LambdaMART Non-Linear Pairwise Ranking ($\text{NDCG}@5 = 0.3791 \pm 0.0738^{}$):* 7-dimensional non-linear feature extraction (
A6) achieves top-tier ranking accuracy while maintaining high discovery novelty ($0.7292$ ).
To understand why each component of this research was developed, the figures below illustrate the core empirical phenomena:
- The Insight: arXiv paper citation counts follow an extreme log-normal power-law distribution where over 85% of citations are concentrated in the top 1% of papers. Citation-only recommenders (
M5) exploit this skew, repeatedly surfacing blockbuster papers while ignoring 99% of long-tail research.
-
The Insight: This
$2 \times 4$ side-by-side t-SNE grid compares 8 embedding checkpoints (M1,M2,M3,M4,M6,M7,M10,M11). While dense Transformer LMs cluster abstracts by broad topic, abstract text alone cannot capture structural co-citation relationships between interdisciplinary papers.
-
The Insight: Plotting Relevance (
$\text{NDCG}@5$ ) against Discovery ($\text{Novelty}@5$ ) reveals the Pareto frontier. Single-signal baselines are trapped in the low-performance region ($\text{NDCG}@5 \le 0.0979$ ), whereas our Multi-Objective System (M9) and Ablations (A2,A3) push performance to$\text{NDCG}@5 = 0.3814$ and$\text{Novelty}@5 = 0.8000$ .
-
The Insight: Lorenz concentration curves plot cumulative paper share vs. cumulative recommendation exposure. Citation-only models exhibit extreme Gini inequality (
$\text{Gini} = 0.82$ ), whereas our Proposed System & Seed-Adaptive Re-Ranker flatten the curve ($\text{Gini} \le 0.40$ ), guaranteeing exposure for uncited and long-tail literature.

The Insight: Comparing all 17 applied techniques across the benchmark confirms that multi-signal re-ranking (
A2,A3,A6) achieves statistically significant gains ($p < 0.001^{***}$ ) over all 11 single-signal baselines.
